I just recently started working out a few months ago, and I've noticed I dont get sore anymore the next day or two after a workout. Does this mean I am not working out hard enough or do you stop getting sore after a while.

Change your routine. You can 'shock' or 'surprise' your body with a new movement, rep count or do a super set. Add weight, lower reps.... all these things keep your body guessing and changing.
And yes, fresh, virgin muscle will become more sore and stay sore longer than a muscle which has adapted to the stress you are enduring. The body has an amazing ability to adapt. Like a marathon runner, baseball hitter, etc.
BTW the vets here are going to be jealous. If you're sore, your growing....
